A few years ago, I used to be the dedicated analyst on call for every last-minute product and leadership request at a Fortune 500 company, often juggling between weekly and monthly business review deck metrics, product one-pagers, and scheduled reporting for operations & customer experience teams. Oftentimes, the issues that occurred were similar in nature. These included incidents like reporting pipeline failures to metric number mismatches between product vs financials and comparison of seasonality trends over years, by geographical market and product type.


By the end of the week, I wasn’t just building data pipelines and dashboards— I was mostly debugging calculations in existing reporting in Excel and Tableau to make sure numbers align, the data pipelines don’t break due to any upstream schema changes, and the dashboard charts load and reconcile with the reported data. Being the single point of contact for all end-to-end data needs supporting a team of finance analysts, product managers, data engineers, and business development leads, that’s when I realized I had become a human chatbot, continuously answering questions about data & performing analysis often beyond the regular business hours due to the presence of global teams. The Slack pings barely stopped, and I started to feel burnt out. I realized this can’t be the sustainable way to manage the overall workload, considering the budget constraints on the team, so one thing was clear - things had to be automated every step of the way. The article helps break down strategies that can be applied to add automation to existing workflows.


Step 1: Consistent Metric Definitions

Different teams may define (and interpret) metrics differently. While sales may consider gross revenue = total sales of products, finance will factor in time of revenue recognition, and FX adjustments (for global markets), etc., while marketing might look at the monthly recurring revenue (MRR) expansions as a measure of revenue. The result may lead to disparate dashboards with numbers that don’t seem to reconcile, leading to reduced trust, therefore slowing down business decision-making.


Solution: Invest in a semantic foundational metric layer — a shared source of truth for definitions. A semantic foundation metric layer consists of a star schema with a data model containing events (e.g., ticket bookings, reservations, purchases, etc.,) defining metrics that can be sliced by various dimensions, including product type, customer, market location, currency, etc. Common foreign join fields(keys) can be used to link between the events data table and dimensions data table to create wide dimension tables that can be used for reporting and analysis. This metric definition is version-controlled, and git committed that allows it to be referenced company-wide for consistent reporting numbers.



Therefore, each team redefining revenue in their own reporting version, team-level dashboards now point to one consistent definition. This is extremely valuable for data reconciliation and mitigating data anomalies between teams reporting v/s financials. Creating a foundation metric layer has to be supported by data asset ownership across teams responsible for managing metric definition via version control, updating, and maintaining documentation. This managed ecosystem of metric governance would enable dashboards to become a single source of truth for stakeholders.


Step 2: Embed data quality & validation checks as part of data pipelines

Data quality checks need to be embedded into the pipeline. This allows to manage data quality issues in a more proactive way to detect upstream schema changes leading to broken joins or missing/ anomalous data populating into the data tables, resulting in mismatched numbers. This can be added to the pipeline in the form of SQL checks validating for missing data, empty data partitions, null primary keys, and reconciliation across systems as part of the data flow. Checks can also be added as part of CI/CD at the time of committing code to production data repositories. Now, if the data pipeline breaks, this can be caught as part of the data pipeline validation check emails before data is added to the table. For critical data pipelines, altering and paging can be added to track resolution.


Step 3: Remove redundancy (as much as possible)

Automation doesn’t need to be limited to the foundation metric pipelines; it should instead be embedded in every task. This may include creating self-serve dashboards for stakeholders to derive their own insights, while freeing up analysts’ time to focus on deep research. This can be further supported by a template of the most widely used SQL queries for business users to pull their own data. The analyst team should also invest in LLM tools to create agentic AI systems built on a foundational semantic layer to help answer data questions for non-technical users in natural language.

 

Adding automation as part of the process flow, including allowing stakeholders to self-serve their data needs, can really help alleviate firefightin,g where analysts could truly now dedicate time to solve harder problems to help drive business growth.

Step 4: Can AI be the first point of contact?

A recent study by McKinsey suggests that onboarding AI as part of analysis workflow, product iteration, testing & market research can reduce routine reporting tasks by up to 40%. This doesn’t mean that the analysts themselves can be replaced by these systems, rather enables them to do even more by handling more complex problems. For organizations to be more adept and productive with these systems:

Start with AI tool being the first point of contact for business users to understand trends rather than just consuming data from dashboards and asking analysts to research trends. The users can interact in native language to dive deeper into the trend root causes and identity potential opportunities for improvement. Utilize these systems to detect anomalies in trends & key metrics and suggested recommendations before the question gets asked in business reviews


Start asking deeper questions to confirm and improve understanding like “What caused a 15% QoQ drop in revenue in June 2025 in EMEA? What product categories were most affected? How can we increase traction and pull back on those not providing any lift? “

AI based Automation would transform (and not replace) current jobs to those that are more proactive, data oriented and strategic.

Step 5: Where automation is embedded as part of the culture, and not just in tools

Reporting and dashboards have effectible widespread adoption only when backed by trusted data and validation framework. One of the most challenging parts of AI tools implementations wasn’t building foundations metric pipelines, was rather managing change.



This facilitation required shared ownership between product, engineering, analytics, finance and marketing teams. Once the teams were exposed to various use cases AI can help solve to improve their productivity, this led to trust being rebuilt, and deep dives turned into structured decision reviews.

With this approach, I went from chasing down mismatched metric numbers, and pipeline delays at midnight to diving deeper into the data to uncover strategies to better serve underserved markets to grow the business.  Robust data validation checks as part of the data pipelines added a layer of trust, and self-serve AI agents have been quite helpful for stakeholders answering quick questions about the data, understanding trends and asking deeper questions about health of the business.
